AI Model Training

Training is the process by which an [artificial intelligence](ArtificialIntelligence) model learns to perform its task. For modern large language models and other deep learning systems, training involves exposing the model to vast quantities of data so it can adjust millions or billions of internal parameters to minimize prediction errors. The training process is computationally intensive, scientifically nuanced, and increasingly expensive — but understanding it is essential to grasping how modern AI works.

The Training Pipeline

Data Preparation

Data is the raw material of model training. For large language models, training data typically comprises trillions of tokens drawn from web pages, books, academic papers, code repositories, and other text sources. For vision models, it consists of millions or billions of labeled or unlabeled images.

Data preparation involves several critical steps:

- **Collection:** Assembling a large, diverse corpus. Sources must be evaluated for quality, relevance, and legal permissibility.

- **Cleaning:** Removing duplicates, filtering low-quality content, stripping personally identifiable information (PII), and handling encoding issues.

- **Deduplication:** Near-duplicate and exact-duplicate removal prevents the model from memorizing repeated content and improves training efficiency.

- **Tokenization:** Text is broken into tokens — subword units that the model processes. Common tokenizers (BPE, SentencePiece, tiktoken) balance vocabulary size against the ability to represent rare words.

- **Filtering:** Applying quality filters, such as perplexity-based filtering (removing text a simpler language model finds surprising) or classifier-based filtering (removing toxic or irrelevant content).

Architecture Design

The architecture defines the model's structure — how information flows through it. Key decisions include:

- **Model type:** Transformer (decoder-only for generation, encoder-only for understanding, encoder-decoder for sequence-to-sequence tasks)

- **Size:** Number of layers, hidden dimensions, and attention heads, which determine the total parameter count

- **Context length:** The maximum sequence length the model can process at once

- **Attention mechanism:** Standard multi-head attention, grouped-query attention, or other variants that trade off capability against efficiency

The Training Loop

The core training loop repeats a simple cycle millions of times:

1. **Forward pass:** A batch of training examples is fed through the model, producing predictions.

2. **Loss computation:** The predictions are compared to the targets using a loss function (typically cross-entropy for language models), producing a scalar measure of error.

3. **Backward pass (backpropagation):** The gradient of the loss with respect to each model parameter is computed.

4. **Parameter update:** An optimizer adjusts the parameters in the direction that reduces the loss.

This cycle continues for one or more passes (epochs) through the training data, though modern large models typically train for less than one epoch on their massive datasets.

Loss Functions and Optimization

Loss Functions

The loss function quantifies how wrong the model's predictions are. For language models, the standard loss is **cross-entropy loss**, which measures how well the model's predicted probability distribution over the next token matches the actual next token. Lower loss means better predictions.

For other tasks, different loss functions apply: mean squared error for regression, contrastive loss for embedding models, or custom losses for specific objectives.

Optimizers

Optimizers determine how model parameters are updated based on gradients:

GPUs

Graphics processing units (GPUs), originally designed for rendering graphics, excel at the parallel matrix operations central to neural network training. NVIDIA's A100 and H100 GPUs are the workhorses of modern AI training, with the H100 offering roughly three times the AI training throughput of the A100. A single frontier model training run may require thousands of GPUs running for weeks or months.

TPUs

Google's Tensor Processing Units (TPUs) are custom-designed chips optimized for tensor operations. TPUs are used extensively within Google for training models like Gemini and are available through Google Cloud.

Training Clusters

Large training runs require clusters of hundreds to thousands of accelerators connected by high-bandwidth interconnects (NVIDIA NVLink, InfiniBand). The networking infrastructure is often as important as the compute hardware, since distributed training requires rapid synchronization of gradients across devices.

Pre-training, Fine-tuning, and RLHF

Modern AI model development typically proceeds through distinct phases:

Pre-training

The foundation phase, where the model learns general knowledge and capabilities from a massive, diverse dataset. For language models, this means predicting the next token across trillions of tokens of text. Pre-training is by far the most computationally expensive phase, often costing tens or hundreds of millions of dollars for frontier models.

Supervised Fine-tuning (SFT)

After pre-training, the model is fine-tuned on carefully curated examples of desired behavior — high-quality question-answer pairs, instruction-following demonstrations, and task-specific examples. This phase shapes the model's "personality" and teaches it to follow instructions rather than merely complete text.

Reinforcement Learning from Human Feedback (RLHF)

RLHF further aligns the model with human preferences. The process involves:

1. **Collecting comparisons:** Human raters compare multiple model outputs and rank them by quality.

2. **Training a reward model:** A separate model learns to predict human preferences from these comparisons.

3. **Policy optimization:** The language model is updated using reinforcement learning (typically PPO or DPO) to produce outputs that the reward model scores highly, while staying close to its fine-tuned behavior.

RLHF has proven crucial for making models helpful, harmless, and honest. Variants include RLAIF (using AI feedback instead of human feedback), constitutional AI (using principles to guide feedback), and direct preference optimization (DPO, which simplifies the RL step).

Scaling Laws

Research by Kaplan et al. (2020) and Hoffmann et al. (2022, the "Chinchilla" paper) established that model performance follows predictable **scaling laws** relating three variables:

- **Compute** (measured in FLOPs — floating point operations)

- **Model size** (number of parameters)

- **Dataset size** (number of training tokens)

Key findings include:

- Performance improves as a power law with each variable, with diminishing returns.

- The Chinchilla scaling laws suggest that compute-optimal training requires scaling data and parameters roughly equally. Many earlier models (like the original GPT-3) were "over-parameterized" relative to their training data.

- These laws enable researchers to predict the performance of larger models before actually training them, informing investment decisions.

Transfer Learning

Transfer learning leverages knowledge from one task or domain to improve performance on another. The pre-training/fine-tuning paradigm is itself a form of transfer learning: the model acquires broad knowledge during pre-training and then transfers that knowledge to specific downstream tasks during fine-tuning.

Transfer learning dramatically reduces the data and compute needed for specific applications. Instead of training from scratch, practitioners can fine-tune a pre-trained model on a few thousand task-specific examples and achieve strong performance.

Distributed Training Techniques

Training models with billions of parameters requires distributing the work across many devices:

- **Data parallelism:** Each device processes a different batch of data with a copy of the full model; gradients are averaged across devices.

- **Model parallelism (tensor parallelism):** The model's layers are split across devices, with each device computing a portion of each layer.

- **Pipeline parallelism:** Different layers of the model are assigned to different devices, and micro-batches flow through them in a pipeline.

- **Fully Sharded Data Parallelism (FSDP) / ZeRO:** Parameters, gradients, and optimizer states are sharded across devices, reducing memory requirements per device.

Modern training runs typically combine multiple parallelism strategies. For example, a 3D parallelism setup might use data parallelism across nodes, tensor parallelism within each node, and pipeline parallelism across groups of nodes.

Training Costs and Environmental Impact

The cost of training frontier AI models has grown dramatically:

The environmental impact is significant: a single large training run can consume as much electricity as hundreds of US households use in a year and generate substantial carbon emissions, depending on the energy source.

Efforts to reduce the environmental footprint include training in regions with renewable energy, developing more efficient architectures and training techniques, and improving hardware efficiency with each generation.

Dataset Curation and Quality

The adage "garbage in, garbage out" applies forcefully to AI training. Dataset quality directly affects model behavior:

- **Diversity** ensures the model can handle a wide range of topics and styles.

- **Quality filtering** removes low-quality, repetitive, or harmful content.

- **Balance** prevents the model from being biased toward overrepresented topics or perspectives.

- **Recency** keeps the model's knowledge current.

- **Legal and ethical review** addresses copyright concerns and ensures training data does not include improperly obtained personal information.

Organizations like Common Crawl provide web-scale text data, but raw web scrapes require extensive cleaning. Curated datasets like The Pile, RedPajama, and FineWeb represent community efforts to build high-quality open training sets.

Evaluation Benchmarks

Standardized benchmarks allow comparing models on consistent tasks:

While benchmarks provide useful signals, they have limitations: models can overfit to benchmark-style questions, benchmarks may not reflect real-world usage, and performance on benchmarks does not guarantee safe or helpful behavior.

Practical Considerations for Custom Models

Organizations training their own models face several practical challenges:

- **Compute access:** Securing GPU clusters, whether through cloud providers (AWS, Google Cloud, Azure) or owned infrastructure.

- **Framework choice:** PyTorch (with libraries like Megatron-LM or DeepSpeed) is the most common framework; JAX is used at Google-scale.

- **Monitoring:** Tracking loss curves, gradient norms, and learning rate schedules throughout training to detect instabilities.

- **Checkpointing:** Saving model states regularly so training can resume after hardware failures.

- **Reproducibility:** Recording random seeds, hyperparameters, and data ordering to enable reproducing results.

For many applications, fine-tuning an existing open model (such as those from the Llama or Mistral families) is far more practical and cost-effective than training from scratch.
